Like so much of the AI economy, the transition from testing to scaling is accelerating the emergence of a new type of enterprise architecture that prioritizes speed and optimization over long-term platform bets.
And at the heart of this new creation? Bringing the data and AI closer together.
While plenty of questions remain unanswered, let’s explore the patterns (and peculiarities) of what’s shaping up to become The 4 Layer AI Stack.

The Emerging Four-Layer Architecture
It seems like only a few years ago that we were debating the merits of a five-layer data stack.
Today, the idea of a siloed data platform feels more like a product of engineering antiquity than a meaningful platform solution. As the enterprise barrels toward production agents, data and AI systems are merging to become a single inseparable system.

This dynamic new reality is forming the basis for a new kind of platform architecture—and it’s far less predictable than the one that came before it.
Among other things, the emerging data + AI stack is being defined by a slushy mix of heterogeneous platform choices and multi-agent architectures that make the system interdependent in its sum while remaining independently complex in its parts.

Layer 1: The Data Layer—Delivering Context to Your Agents
Once lovingly described as the “modern data stack,” your data estate—and the systems and pipelines that support it—forms the bedrock of your production-capable agent.
The primary output of the data layer is to provide access to a database of valuable (and AI-ready) business data that’s been:
- Validated
- Semantically enriched
- Securely governed
- Made fit for purpose
This foundational data layer will form the primary source of truth for your agentic use cases. The deeper you integrate into the data stack, the more valuable your agent will become.
Your data layer might be a single cloud-based storage layer (like Snowflake or Databricks) or a mix of multiple extensible platforms that provide access to structured and unstructured data sources, streaming data, and anything else your agents might want or need to consume.
Google Cloud Platform, Databricks, and AWS have all emerged as early leaders in the cloud AI stack, but like everything in AI, it’s still too early to call a “winner.” (Though I’m sure there’s a Polymarket for it.)
Layer 2: The Semantic Layer—Bridging the Gap Between Data and AI
If the data layer was all about delivering access to the data, the semantic layer is all about making it useful—and cost-effective—for AI.
Think of it like this: identifying that “UserID 12345 has OrderID 67890,” is helpful. Identifying that “frequent flyer Mark is in the top 10% for individual tickets sales and recently experienced a flight delay” is powerful. But more context always means more costs. And just because all of that context is valuable doesn’t mean that it’s necessary.
According to Anthropic, every agent has a goldilocks zone where context and cost intersect. Too little context and your agent won’t be valuable; too much context and it quickly becomes too expensive to scale.
The semantic layer of an agent defines that zone by maximizing an agent’s understanding of the data and minimizing the volume it actually retrieves. A lot like putting blinders on a horse, the semantic layer helps your agents focus on only those the datasets required to complete the task
The output of an effective semantic layer will include:
- Consistent metadata—standards have been established that dictate how the data will be used, like, metric definitions, documented relationships, and registered sample queries.
- Documented context—transparent provenance and lineage is provided for agents to interpret and explain outputs.
Referred to by one leader I spoke to as the “Data SS Layer” (Data Self-Service Layer), your semantic layer will help your agent surface meaningful and contextually relevant data points when it’s gainful and appropriate to do so.
Layer 3: The Agent-Build Layer—Constructing the AI System
If the data layer established the data, and the semantic layer made it useful for AI, the agent-build layer is where we’ll establish the architecture to activate it.
Unlike the data layer, the agent layer isn’t a mix of interconnected systems—it’s a vertically integrated solution to drag and drop agent workflows.
Now, this is where things get really interesting. While some dominant platforms have emerged for specific verticals, agent-builders are still firmly in the proliferation stage, with new platforms emerging all the time to optimize for speed, use-case, and everything in between. Which makes choosing a single builder a bit like choosing a single pair of shoes. It all depends on the occasion.
Rather than betting on a single platform, leading enterprise teams are building agents across multiple environments simultaneously. This multi-agent approach empowers builders to optimize for specific outcomes over platform providers—from agnostic agent-builders like Langchain and point solutions like Agent Bricks, to platforms like Decagon that are designed for customer experience.
My advice here is, don’t assume you’ll standardize on a single agent-building platform—because you probably won’t. Plan for diversity, and build the right frameworks and accountability to manage it appropriately. Which brings me neatly along to the final layer of the 4 Layer AI Stack…
Layer 4: The Trust Layer
If your data products were a house built on a rock in the flatlands, your agent is a 500-story skyscraper built on the beach during hurricane season. And you’re going to need the right foundation—and some great insurance—if you want to move in quickly.
In classical applications, software engineers could reasonably rely on the predictability of inputs, deterministic logic, and a well-defined testing strategy to deliver reliable results for their stakeholders.
But AI ≠ traditional software.
When it comes to AI systems — particularly those built on broad foundational LLMs — none of the classical assumptions hold. Outputs are non-deterministic by nature; structured and unstructured data sources change constantly; agent outputs become the inputs for agentic workflows; and the architecture that orchestrates this madness is heterogeneous from the start.

If you want to protect the reliability of agents end-to-end, you need an observability solution baked into the architecture that’s designed for both sides of that system together—the data inputs and the agent outputs.
From monitoring for quality metrics like freshness and lineage to observing output metrics like prompt adherence and completion rate, your data + AI observability isn’t just one single layer—it’s an extensible and comprehensive solution that extends into every other layer of the AI stack—validating the data that feeds it, the semantics that explain it, and the agent that retrieves and dynamically activates it.
Leaders managing hundreds of agents in production have all clearly identified observability – including traces, monitoring, and more – as key to enabling TRUSTED outcomes for agentic solutions. That’s not a nice-to-have. That’s a critical platform component.
And the most sophisticated teams are connecting output quality metrics directly back to input data quality issues. For example, a slow customer support agent might be caused by:
- A data freshness incident that delayed context
- An excited engineer who changed a system prompt
- A dropped field that broke a schema

The Future is Here—But Are You Ready?
As we think about the emergence of the AI stack, speed might be the headline, but it’s certainly not the conclusion.
When it comes to agents, true production velocity means building for both flexibility and reliability—from the input all the way down to the agent output.
Build the context layer: Your agent will only ever be as valuable as the data that informs it. Get your data estate in order and establish the context to make it actionable.
Plan to be multi-platform: Don’t try to standardize on day one. You might get there one day, but it certainly won’t be today. Plan for diversity and make platform decisions to support it.
Prioritize trust for inputs and outputs: If you can’t validate the inputs and outputs, you aren’t ready for production. Unit tests and native solutions might offer coverage within a limited purview, but they’ll collapse under the complexity of the AI stack. Prioritize end-to-end observability in development and you won’t have to regret it in production.
